Introduction to Knowledge Graph Question Answering

Large Language Models (LLMs) have demonstrated significant capabilities in Knowledge Graph Question Answering (KGQA) by utilizing planning and interactive strategies to query knowledge graphs. Many existing methods depend on SPARQL-based tools for information retrieval, allowing models to provide precise answers. Some techniques enhance the reasoning abilities of LLMs via tool-based reasoning paths, while others implement decision-making frameworks that interact with knowledge graphs using environmental feedback.

Challenges in Current Approaches

Despite advancements, these strategies often blur the lines between tool usage and actual reasoning, which can lead to decreased interpretability, reduced readability, and an increased risk of generating incorrect or irrelevant responses. This phenomenon occurs when models overly rely on parametric knowledge, leading to what is termed hallucinated tool invocations.

Proposed Solutions

To overcome these limitations, researchers have examined memory-augmented techniques that provide external knowledge storage to facilitate complex reasoning. Previous studies have integrated memory modules to retain long-term context, enhancing decision-making reliability. Traditional KGQA methods utilized key-value memory and graph neural networks, while recent LLM-based techniques have capitalized on large models for improved reasoning. Some approaches employ supervised fine-tuning for better comprehension, while others utilize discriminative methods to reduce hallucinations. However, a clear separation between reasoning and tool invocation remains a significant challenge.

Introduction to MemQ

Researchers from the Harbin Institute of Technology have introduced a novel framework called Memory-augmented Query Reconstruction (MemQ) aimed at distinguishing reasoning from tool invocation within LLM-based KGQA. MemQ establishes a structured query memory that utilizes LLM-generated descriptions of decomposed query statements, promoting independent reasoning. This method improves readability by outlining explicit reasoning steps and retrieving relevant information based on semantic similarity.

Key Components of MemQ

MemQ is designed around three critical tasks: memory construction, knowledge reasoning, and query reconstruction. Memory construction focuses on storing query statements with natural language descriptions for efficient retrieval. The knowledge reasoning task generates structured multi-step reasoning plans to ensure logical coherence in answering queries. Finally, query reconstruction retrieves relevant statements based on semantic similarity and assembles them into a final query. By fine-tuning LLMs using explanation-statement pairs and employing an adaptive memory recall strategy, MemQ achieves superior performance compared to previous methods.

Experimental Validation

The performance of MemQ is evaluated using WebQSP and CWQ datasets, with metrics such as Hits@1 and F1 scores. Comparisons are made against tool-based baselines like RoG and ToG. Built on Llama2-7b, MemQ outperforms earlier methods, showcasing enhanced reasoning through a memory-augmented approach. Analytical experiments reveal improvements in structural and edge accuracy, while ablation studies confirm its effectiveness in balancing tool usage and reasoning stability.

Conclusion

The study presents MemQ, a memory-augmented framework that effectively distinguishes LLM reasoning from tool invocation, thereby minimizing hallucinations in KGQA. MemQ advances query reconstruction and reasoning clarity through the incorporation of a query memory module. Experiments on WebQSP and CWQ benchmarks exhibit that MemQ surpasses existing methodologies, achieving state-of-the-art results. By clarifying the relationship between tool utilization and reasoning, MemQ enhances the readability and accuracy of LLM-generated responses, providing a more effective strategy for KGQA.
