Unlocking Metacognitive Insights in LLM-based Problem Solving
Large language models (LLMs) have shown impressive reasoning abilities, but do they possess metacognitive knowledge? Researchers have developed a novel approach to extract and leverage LLMs’ implicit knowledge about mathematical skills and concepts, enhancing mathematical reasoning.
The innovative method involves using a powerful LLM like GPT-4 to assign fine-grained skill labels to mathematical questions, creating a “Skill Exemplar Repository” – a curated set of questions tagged with interpretable skill labels.
During inference on new math problems, the LLM identifies the most relevant skill from the repository and is given exemplar questions/answers associated with that skill as in-context examples before attempting the solution. This approach achieved an impressive 11.6% improvement over standard prompting methods on challenging datasets.
Importantly, the extracted skill knowledge transfers effectively to enhance the performance of weaker LLMs and shows strong generalization across models and datasets. This study opens up exciting new avenues for enhancing LLMs’ mathematical reasoning capabilities.
